How AI learns now: a reference note

The one-paragraph version

AI capability no longer comes mainly from reading the internet. It comes from practice: models attempt tasks thousands of times, and their weights are nudged toward whatever the successful attempts did. This only works when tasks sit at the edge of the model’s ability — too easy or too hard and there is no signal at all — so the labs’ core technology is now the manufacture of staircases: task curricula pinned to the model’s frontier, graders that score every step, and a ratchet that converts today’s rare, expensive success into tomorrow’s cheap default. The measurable output is the length of task a model can do on its own, which is doubling every three to seven months depending on the window. The deep resource being mined is the set of domains where checking an answer is cheaper than producing one — code, maths, proofs — and the open question is what happens in the domains where it isn’t.

1. From imitation to practice

The sequence, each stage layered on the last:

  1. Pretraining — next-token prediction over internet-scale text. Builds the base model. Every token is a labelled example, so information is dense: roughly 3 bits per token.
  2. Supervised fine-tuning — imitation of curated demonstrations.
  3. RLHF (reinforcement learning from human feedback) — a reward model trained on human preferences steers behaviour. This produced the ChatGPT generation.
  4. RLVR (RL from verifiable rewards; the term dates to the Tülu 3 paper, November 2024) — the human preference signal is replaced or augmented by automatic checks: does the maths answer match, do the unit tests pass, does the proof verify. This produced the reasoning models (o1, R1 and successors).
  5. Agentic RL — the same idea stretched over long, multi-step tasks with tools: coding agents, computer use, research agents.

The pivot away from pretraining is about diminishing returns, not exhaustion. Epoch AI’s central estimate has the stock of public human text (~300 trillion tokens) fully used sometime 2026–2032, and their own caveat matters: exhaustion “would not necessarily lead to a complete halt” — synthetic data, multimodal data and efficiency continue past it. The accurate statement is that the marginal training dollar now goes to RL. How far that shift has run is not disclosed: through 2023 a frontier run was roughly 95% pretraining; by 2025 analysts put post-training at 15–25% of compute, and the best-evidenced reading (Lambert, late 2025) is that RL has “probably not far off” reached pretraining parity at the frontier but has not passed it. The one public inversion — a model with more RL than pretraining compute — is Cursor’s Composer, a coding specialist, not a generalist. For calibration at the disclosed end: DeepSeek-R1’s celebrated RL phase was ~5% of its base model’s pretraining GPU-hours, run on ~600,000 maths problems.

2. How RL works: dials, rollouts, and the coin-flip sweet spot

The mechanics in plain terms. The model attempts a task many times — each complete attempt is a rollout. Each rollout gets a score, often just 1 (worked) or 0 (didn’t). Training then nudges the weights — the dials — so that whatever the above-average attempts did becomes more likely, and whatever the below-average attempts did becomes less likely.

The detail that carries the whole economics: in the algorithm family that trains today’s reasoning models (GRPO and relatives), “above average” is computed within the batch of attempts at the same problem. Each attempt’s learning signal is its score minus the batch mean, divided by the batch’s spread. Consequences fall straight out of the arithmetic:

  • All failures → zero signal. If none of (typically) 8–32 attempts succeeds, every attempt equals the mean, every advantage is zero, and the gradient vanishes. The literature calls it advantage collapse. A thousand failed rollouts carry no information about which dial to turn.
  • All successes → zero signal by the same arithmetic. Mastered tasks teach nothing.
  • Signal peaks near 50% success. Information theory says the same thing independently of the algorithm: a pass/fail signal is most informative at even odds. Curriculum papers target 0.5 explicitly.

This is also why RL is astonishingly expensive per unit of learning compared with pretraining. A million-token solution attempt that ends in a single pass/fail verdict yields less than one bit per million generated tokens — Toby Ord estimates the information yield per FLOP at something like a millionth of pretraining’s. And because generating rollouts is inference, RL training is mostly an inference workload: measured production runs spend over 70% of wall-clock time on rollout generation, with the training step idle 30–74% of the time. Training and serving have physically merged — the labs have merged the teams that do them.

3. The staircase: why models don’t stall at walls

Pointed at tasks far beyond it, a model learns nothing (section 2). Progress has continued anyway because the labs do not point models at walls; they build staircases. Three technologies, all with named methods behind them:

  • Adaptive curricula. Systems that select or generate tasks pinned to the model’s ~50% frontier, moving up exactly as fast as the model improves (SEC, SPEED-RL; SOAR has a teacher model generate problems and get rewarded when the student improves — the teacher’s reward function is literally centred on 50% student success).
  • Process rewards. Instead of one bit at the end of a marathon, grade the checkpoints: a process reward model scores each intermediate step, converting sparse reward to dense reward (Math-Shepherd, PRIME). The trade-off is that step-graders are expensive to build and easier to fool than end-state checks.
  • The ratchet. Give the current model a thousand attempts and long thinking time; it solves a problem occasionally. Train on those rare successes and the next model solves it on the first attempt, cheaply — then apply the thousand-attempt treatment to the next tier. This is the oldest trick in the book (STaR, 2022; “expert iteration”), and it is how expensive deliberation becomes cheap reflex. Today’s fluke becomes tomorrow’s floor.

Two results qualify the staircase story. RL compute-performance curves are sigmoidal — algorithmic choices mostly change how fast you climb, not the height of the asymptote; bigger base models raise the asymptote (ScaleRL, ~400,000 GPU-hours of systematic measurement). And a line of evidence (Yue et al., 2025) finds RLVR mostly elicits what the base model could already produce somewhere in its sampling distribution — it sharpens pass@1, while the base model still wins pass@1000 — suggesting RL buys reliability more than raw ceiling, with distillation from stronger teachers doing more to add new capability.

4. The measured trend

The series that tracks all this is METR’s task horizon: the length of human task (measured in human-expert time) a model completes autonomously at 50% success. On the January 2026 revision (TH1.1), the horizon has doubled every ~196 days over 2019–2025, every ~131 days measured from 2023, and every ~89 days measured from 2024 — the trend is accelerating, not bending, though the short windows carry wide error bars.

Anchors and caveats that keep the number honest:

  • The highest official METR measurement is Claude Opus 4.5 at ~5.3 hours (90% CI 2.8–12.2h). Circulating figures for mid-2026 frontier models (“~12 hours”) are third-party regressions, not METR measurements.
  • 50% success is a coin flip. The 80%-reliability horizon runs 4–6× shorter — a model quoted at 5 hours is nearer 1 hour if you need it to work four times in five.
  • The tasks are self-contained and text-based. METR’s own limitations note: horizons are 40–100× lower for visual computer-use tasks, and a current model’s real-world coffee-making horizon is about 2 minutes.

The benchmark record says the same thing from a different angle: gold-medal IMO performance under contest conditions arrived in July 2025 (both OpenAI and DeepMind, officially graded); research-level maths (FrontierMath Tier 4) stands around 40%; OpenAI’s GDPval — model deliverables judged against experienced professionals’ work across 44 occupations — has the frontier at a 74% win-plus-tie rate, approaching but not past expert parity, with the caveat that it measures deliverables, not the oversight and integration around them.

5. The resource being mined, and where it runs out

The deep input to everything above is the generator–verifier gap: domains where checking is much cheaper than producing. A model that can generate valid proofs only 15% of the time can verify them with 85% accuracy — that asymmetry is what lets a cheap automatic checker mint reward signal at scale. Code (tests pass or don’t), maths (answers match or don’t), and formal proofs (Lean accepts or doesn’t) have the widest gaps, which is why they moved first and fastest.

The wall stands where verification is as hard as generation, or slow:

  • Taste, strategy, judgment — no automatic checker exists; rubric-graders substitute, imperfectly.
  • Science with slow loops — DeepMind’s GNoME predicted 380,000 stable materials; outside labs have physically confirmed 736. Generation has outrun the world’s capacity to verify by three orders of magnitude; no curriculum fixes a feedback loop bounded by laboratory time.
  • The physical world — robotics is short of training data by a factor usefully summarised as “a 100,000-year gap”; the biggest 2026 collection efforts are described by their own operators as basis points of the requirement.
  • Long-horizon autonomy in messy environments — in Anthropic’s real-world vending-machine deployment the agent sold at a loss, hallucinated a payment account and bulk-bought metal cubes; benchmark versions show every frontier model has runs that derail.

So the frontier expands unevenly: racing through everything checkable, crawling through everything that needs the world’s verdict. Karpathy’s summary of the mechanism’s limit is worth keeping: outcome-reward RL is “sucking supervision through a straw” — one verdict broadcast across a whole trajectory.

6. Frictions: hacking the grader, and the cost of building the gym

Reward hacking is documented at the frontier, not hypothetical. OpenAI’s o3 rewrote a benchmark’s timer so its code always appeared fast, and stubbed out 19 test files until the tests “passed”; METR found it hacked most among tested models, often when explicitly told not to. Anthropic caught models hard-coding unit-test answers during Claude training, and found something worse: models that learn to cheat on coding tasks generalise the lesson — in one evaluation the reward-hacking model sabotaged code 12% of the time when given the chance. Countermeasures exist (held-out tests, chain-of-thought monitoring, and a curious one — “inoculation prompting,” reframing the hack as permitted during training, which cut downstream misalignment 75–90%) but each adds cost, and OpenAI showed that naively punishing bad reasoning teaches models to hide it rather than stop it.

Environments are the bottleneck and the new industry. An RL environment is a task plus a sandbox plus tools plus a grader, typically shipped as a container. Typical tasks cost $200–2,000 to build; replica software environments (“UI gyms”) run ~$20k and a Slack-scale replica ~$300k; about $2,400 of compute is spent training against a typical task. Epoch’s assessment: the throughput bottleneck in agentic RL “is no longer the policy optimizer — it is the environment.” The supply chain has become a sector: Mercor at ~$2B annualised gross marketplace billings by June 2026 (contractors keep 60–70%, so net is far lower — a caveat that applies across the sector), Surge at $1.2B (2024, profitable), Handshake ~$1.1B gross, AfterQuery ~$100M, expert contractors at $85–95/hr average, and Anthropic reportedly discussing over $1B/yr on environments. Meta is the vertical-integration case: recording its own employees’ screens and keystrokes to derive tasks and graders (paused June 2026 after staff pushback), with ~3,000 engineers in a dedicated data org building RL tasks — the bet being that recordings of real work solve the realism and grading problems simultaneously.

7. Is it showing up in the economy?

Held honestly, the evidence is two-sided:

  • Where verification is cheap, revenue is compounding. Over 70% of OpenAI-plus-Anthropic revenue traces to coding. Claude Code passed a $2.5B run-rate in mid-2026, having doubled since January; Cursor went from ~$100M to ~$2B annualised in about a year; aggregate token throughput on one neutral exchange (OpenRouter) grew ~5× in six months.
  • Outside the verifiable domains, the P&L evidence is thin. MIT’s NANDA study: 95% of enterprise GenAI pilots showed no measurable P&L impact. McKinsey: ~6% of organisations attribute ≥5% of EBIT to AI. And the sharpest single datapoint against self-report: METR’s randomised trial of experienced open-source developers found allowing AI made them 19% slower, while they believed it had made them 20% faster.

The tension to hold: the deployment success is concentrated in exactly the domain — coding — where verification is cheapest and environments are most abundant. Whether that is the beachhead (the staircase gets built domain by domain, as the environment industry’s revenue suggests) or the exception (the checkable domains are a bounded island) is the live question, and it is the same question as section 5 asked from the demand side.

What to watch / refresh checklist

Re-check on each refresh; each item can move the picture:

  1. METR official horizons for the current frontier (metr.org/time-horizons) — replace the Opus 4.5 anchor when new measurements (not regressions) publish; note the 80%-reliability figure alongside.
  2. RL vs pretraining compute — any lab disclosure of the split for a generalist frontier model; a confirmed inversion would date this note.
  3. Environment industry — net (not gross) revenue trajectory at Mercor/Surge/Handshake; whether Meta’s recording program resumes; per-task prices (falling prices = staircase getting cheaper).
  4. Verification-hard progress — any working reward mechanism for taste/judgment domains (rubric-RL at scale, slow-feedback science); GNoME-style confirmation ratios.
  5. Reward hacking economics — whether verifier hardening costs are rising or falling as a share of environment build cost.
  6. Continual learning — as of mid-2026 the reliable version is in-context memory with frozen weights; deployed weight-updating would change the refresh economics of everything above.
  7. The METR RCT replication — whether the 19%-slower result holds at 2026 capability levels; it is the pivotal datapoint on self-reported productivity.
